Scaling efficiency: 87-94%

Dataset Details

Baseline Generation (28.56 GB)

Method: EC2-based Python generator with streaming S3 upload - Output: 224 chunks × ~130MB = 28.56 GB gzipped - Rows: 448,000,000 - Duration: ~6 hours on c6i.4xlarge - Storage: s3://your-device360-bucket/device360/

10x Multiplication (300 GB Equivalent)

Method: In-database INSERT SELECT with device_id suffix

INSERT INTO device360.ad_requests
SELECT
    event_ts, -- Preserved timestamps
    event_date,
    event_hour,
    concat(device_id, '_r', toString(replica_num)) as device_id,
    -- ... other columns ...
FROM device360.ad_requests
CROSS JOIN (SELECT number as replica_num FROM numbers(9)) AS replicas

Result: - Rows: 4,480,000,000 (4.48B) - Unique Devices: 100,000,000 (100M) - Time Range: Identical to baseline (2025-11-01 to 2025-12-11) - Execution: 5 minutes at 32 vCPU - Storage: 36.14 GiB compressed

Why This Approach: - Minimal changes (preserves original data characteristics) - Preserves time range (same temporal distribution) - Fast execution (5 min vs 60+ hours for full regeneration) - Maintains data distribution and patterns

Table Schema

CREATE TABLE device360.ad_requests (
    event_ts DateTime,
    event_date Date,
    event_hour UInt8,
    device_id String,
    device_ip String,
    device_brand LowCardinality(String),
    device_model LowCardinality(String),
    app_name LowCardinality(String),
    country LowCardinality(String),
    city LowCardinality(String),
    click UInt8,
    impression_id String
)
ENGINE = MergeTree()
PARTITION BY toYYYYMM(event_date)
ORDER BY (device_id, event_date, event_ts) -- ⭐ Device-first ordering
SETTINGS index_granularity = 8192

Critical Design Choices:

  1. ORDER BY (device_id, event_date, event_ts): - Co-locates all events for same device - Enables fast point lookups (215ms for 4.48B rows) - Provides 149:1 compression on device_id column

  2. Bloom Filter Index on device_id: sql ALTER TABLE device360.ad_requests ADD INDEX idx_device_id_bloom device_id TYPE bloom_filter GRANULARITY 4; - Skips 99.9% of granules for single device queries - 83x speedup for point lookups (781ms → 12ms on 448M baseline)

  3. LowCardinality for categorical columns: - app_name, country, city, device_brand, device_model - Achieves 43-50:1 compression ratio - Faster aggregations (dictionary-encoded integers)

Performance Results

Production Recommendations

Optimal Configuration

✅ 32 vCPU for production: Best balance for mixed workload (point lookups + aggregations) ✅ device_id-first ordering: Essential for Device360 use case ✅ Bloom filter on device_id: Required for sub-second point lookups ✅ LowCardinality encoding: Critical for categorical columns

Query Optimization

Point Lookups (already optimal): - Current: 215ms warm cache - Meets production SLA (<500ms) - For <100ms: Consider distributed tables or covering projections

Aggregations (consider materialized views): - Current: 7s full table scan acceptable for analytics - For real-time dashboards: Pre-aggregate with MVs - Daily metrics (refresh every 5 min) - Top devices (hourly) - Geographic summaries - App performance

Bot Detection: - Session analysis: Leverage device_id ordering - Temporal patterns: event_ts sorting - Consider specialized MV for fraud indicators

Cost-Performance Analysis

Ingestion Cost (32 vCPU)

Cost optimization: - Use 16 vCPU for non-urgent batches (50% cost reduction, 1.9x longer) - Schedule large batches during off-peak hours

Query Cost (32 vCPU)

Steady-state workload: - Point lookups: 47 QPS sustainable - Aggregations: 2 QPS for full scans - Mixed: 30-40 point lookups + 1-2 aggregations concurrently

Cost optimization: 1. Scale down to 16 vCPU during off-peak (50% cost reduction) 2. Use materialized views for frequent aggregations (10-100x speedup) 3. Enable query result caching (10-100x speedup for repeated queries)

Scaling Roadmap

Current Capacity (32 vCPU, Single Node)

10x Growth (3TB source data)

Projected Performance: - Ingestion: 204 min (3.4h) at 32 vCPU - Storage: ~360 GiB compressed (manageable) - Point lookups: Stable with Bloom filter - Aggregations: May need materialized views

Architecture Recommendation: - Consider distributed ClickHouse cluster (3 nodes) - Replicated tables for high availability - Distributed queries for horizontal scaling - Tiered storage (SSD for recent, S3 for historical)
